In the stdied model, a nmber of nmanned aerial vehicles (UAVs) are sed as aerial base stations to collect data from the clster heads (CHs) of a set of MM clsters. To minimize the CHs transmit power while satisfyin the rate reqirements of MM devices, an optimal schedlin and resorce allocation mechanism for CH-UAV commnications is proposed. First, sin the qee rate stability concept, the minimm nmber of UAVs as well as the dwellin time that each UAV mst spend for servicin the CHs are compted. Next, the optimal resorce allocation for the CH-UAV commnication links is determined sch that MM devices rate reqirements are satisfied with a minimm transmit power. Simlation reslts show that, as the packet transmission probability of machines increases, the minimm nmber of UAVs reqired to arantee the qee rate stability of CHs will also sinificantly increase. Or reslts also show that, compared to a case with pre-deployed terrestrial base stations, the averae transmit power of CHs will decrease by 68% when UAVs are sed. I. INTRODUCTION Machine-to-machine (MM) commnications allow the interconnection of a massive nmber of machine type devices (MTDs) []. In particlar, MM commnications can be sed in many Internet of Thins (IoT) applications sch as intellient transportation, health care monitorin, smart rid, and pblic safety []. To effectively spport commnications between the massive nmber of MTDs, a reliable wireless infrastrctre is needed. In sch MM scenarios, machine type devices mst transmit their data to some existin base stations in the wireless network. However, in areas which experience an intermittent or poor coverae by terrestrial wireless networks, battery-limited MTDs are not able to transmit their data to far away base stations de to their power constraints. Frthermore, de to the varios applications of MTDs, they miht be deployed in environments with no terrestrial wireless infrastrctres sch as montains and desert areas. In sch challenin scenarios, nmanned aerial vehicles (UAVs) can be sed as flyin base stations to provide reliable and enery-efficient plink MM commnications [] [4]. In particlar, UAVs can play a key role in enablin MM commnications when the access to terrestrial wireless networks is limited or navailable. De to the aerial natre of the UAVs and their hih altitde, they can be effectively deployed to redce the shadowin and blockae effects [4] [6]. Therefore, the UAVs can intelliently move for collectin MTD data. However, to leverae the se of UAVs to collect MTD data, efficient techniqes mst be developed for resorce allocation, network deployment, and mltiple access [7] [9]. De to the massive nmber of MTDs, optimizin the resorces needed for plink mltiple access becomes hihly challenin. In this reard, clsterin the MM devices and employin clster heads (CHs) for collectin the MM data and sendin it to the aerial base stations, is an effective way to address the massive access problem [] [3]. In clstered MM networks, some MTDs can act as clster heads in order to relay the received packets from the clster members (CMs) to the base stations. In this case, different criteria sch as qality-of-service (QoS), and power consmption of the MTDs can be considered for clsterin of the devices [] and []. Hence, in a clstered MM network that is covered by UAVs, the clster heads are able to send their data to the nearest UAVs with a low transmit power. The work in [] investiated the optimal deployment and trajectory of a sinle UAV for maximizin downlink coverae. However, the model presented in [] does not consider mltiple UAVs case. In [3], UAVs are sed to efficiently collect data from rechareable CHs. Nevertheless, the work in [3] does not address the problem of optimal schedlin and resorce allocation in UAV-based MM commnications. While some stdies sch as [] and [4] addressed the problem of MM schedlin and resorce allocation in celllar networks, they do not consider the se of UAVs as aerial base stations in their model. Also, recent works on clsterin, sch as [5], do not incorporate UAVs in their model. The main contribtion of this paper is to develop a schedlin and resorce allocation framework for enery-efficient CH- UAV commnications. In particlar, we consider a network in which a nmber of UAVs mst provide plink transmission links to collect the data from the CHs of a nmber of MTD clsters. Usin the qee rate stability concept, we derive the minimm nmber of reqired UAVs to serve clster heads as well as their dwellin time over each CH. Next, considerin a minimm rate reqirement for CHs, we propose an optimal resorce allocation mechanism for CH-UAV commnications sch that the total transmit power of CHs is minimized. Or
2 reslts show that, the se of UAVs can yield p to a 68% redction in the CHs transmit power as compared to a case with pre-deployed terrestrial base stations. Frthermore, based on the packet transmission probability of the MTDs, or reslts determine the minimm nmber of UAVs needed for the rate stability of the CHs qees. The rest of this paper is oranized as follows. Section II presents the system model. In Section III, we present the optimal UAV schedlin model. In Section IV, we introdce the proposed resorce allocation mechanism. Simlation reslts are presented in Section V while conclsions are drawn in Section VI. II. SYSTEM MODEL Consider a nmber of MTDs distribted over a iven eoraphical area. These MTDs form a set of clsters G = {G, G,..., G G }. In each clster, an MTD is selected as a CH that is responsible to send the data packets of all of its clster members sin plink transmission links. Let I be the set of the indices of CHs. The size of each data packet pertainin to CH I is D. In this area, mltiple UAVs (at low altitdes) are sed as flyin base stations to collect data packets from the CHs. We also let U be the set of U available UAVs. The UAVs mst dynamically move and stop over the CHs to collect the plink data. Clearly, the dwellin time of each UAV over each CH depends on the nmber of packets that the CH wants to transmit. For mltiple access, we consider an orthoonal freqency division mltiple access (OFDMA) scheme with Z resorce blocks (RBs) each havin a bandwidth B z. Let z be the nmber of RBs assined to a iven UAV. For each UAV, we define a vector d = [d ] G with each element bein the dwellin time of UAV needed to cover CH drin T. We also define P,z as the transmit power that a CH needs for reliable data transmissions over RB z. In Fire, we show an illstrative example with three clsters which are bein served by two UAVs. In each clster, there is one CH that mst relay the packets of clster members to its servin UAV drin the dwellin time. In this scenario, since the size of clster G is larer than other clsters, UAV needs to stay loner over clster. However, the sizes of clsters G and G 3 are small enoh ths allowin UAV to chane its position and provide service to G and G 3. Next, we present the qee model for each clster member. A. Qee of reqests In each clster, the qee of data packets at the CH contains all of the data packets received from the CMs. At each time slot, a CM transmits its data packet with a probability p to the CH. Let a,t be the arrival process of a iven data packet to the CH of clster G drin time slot t. We assme that the data packets from each CM will immediately trier an arrival process of data packet to the CH. Drin each time slot, a,t can chane from which indicates that none of CMs in G transmit data, to G, indicatin that all of the MTDs in G transmit a data packet to the UAV. (4) To arantee that the qee lenth of CHs does not become infinite, the nmber of UAVs and their dwellin time for servin the CHs mst be sfficient. Therefore, we first find the minimm nmber of UAVs and their dwellin time over the CHs which ensre the qee rate stability. Next, to establish the sccessfl plink transmission of CHs, we determine the optimal nmber of resorce blocks and minimm transmit power for each CHs. In this case, we need to address the problem of optimal resorce allocation for enery-efficient CH-UAV commnications. III. SCHEDULING AND RESOURCE ALLOCATION Here, we first determine the minimm nmber of UAVs and their dwellin time to ensre that the qee lenth of CHs remains bonded over time. Then, we propose an optimal resorce allocation (RA) mechanism for the UAVs.

The rate stability theorem in [6] introdces the followin rle for stabilizin a mlti-qee network: make schedlin decisions sch that the averae service time and the arrival rates are well defined and satisfy ā,t d,t for each qee. (5) Based on the definition of Λ, the minimm nmber of UAVs is the nmber for which Λ is not empty for the iven arrival rates. For example, in Fire, two cases are shown for a scenario in which there are two clsters of MTDs. In the first case shown in Fire (a), the averae arrival rates of qees in CHs (a, a ) are low enoh sch that Λ is not [ empty ] for d a servin UAV, which means Λ = {d d =, d + d =, ā,t d, ā,t d }. Ths, one UAV can collect the packets from both CHs and arantee the rate stability for both qees. In Fire (a), the x-axis and y-axis, respectively, show the dwellin of UAV on CH and CH for T =. When the averae arrival rate of the qees increases from (a, a ) to (b, b ), then, as shown in Fire (a), Λ becomes empty for the sinle UAV case. Therefore, only a sinle UAV cannot arantee the rate stability. Based on Fire (b), to obtain a nonempty Λ, at least two UAVs are needed to collect the packets of each qee. In Fire (b) the x-axis and y- axis, respectively, show the dwellin time of UAV on CH and UAV on CH for T =. Then we have Λ = {D = [d ; d ] d = [, ] T, d = [, ] T }. Ths far, we have determined the minimm nmber of UAVs as well as their dwellin time to arantee the qees stability of CHs. Next, for each CH, we find the optimal nmber of resorce blocks and minimm transmit power reqired for the sccessfl and enery-efficient plink transmissions. d x B. Resorce Allocation for CHs and UAVs In or model, the system resorces inclde the resorce blocks assined to UAVs and the transmit power of each CHs. Each CH mst transmit its packets with a minimm power sin the assined resorce blocks. The vector z = [z ] U indicates the nmber of resorce blocks assined to UAV. P = z P,z is the sm of the transmit power of CH over all of the RBs assined to UAV. H z is the channel ain between UAV and CH on each sb-channel z, and β =.5 ln(5p is the SNR ap for M-QAM modlation with P e) e bein the maximm acceptable error probability [7]. Here, we have H z = ( 4πh ) ν where ν is the path loss exponent, λ h is the distance of UAV from clster head, and λ is the wavelenth. P max and Z are, respectively, the maximm transmit power of CH and the maximm nmber of available RBs. In the defined optimization problem (6), constraint (7) arantees that each CH can send one packet drin the time that the UAV covers it. Also, (8) indicates the maximm nmber of resorce blocks available for UAVs. (9) shows the maximm transmission power of CHs. In eneral, solvin (6) is challenin de to the presence of both inteer, and continos, variables as well as a nonlinear constraint (7). Ths, we relax this problem by assmin that each CH will se the same transmit power on all sb-carriers. 4 where each element of the matrix P = [P ] G U indicates the transmit power of each CH, when it is serviced by UAV. Clearly, the optimization problem in () is a mixed inteer prorammin problem. We relax this optimization problem by considerin continos vales for variable z. Obviosly, the objective fnction in () is linear, and, hence, it is convex. Frthermore, considerin the fact that the fnction ( x )x y is a convex fnction on (x, y) R, constraint () is also convex as it is a sb-level set of a convex fnction on z and P. Constraints () and (3) are also the sb-level sets of convex fnctions. Conseqently, the optimization problem in () is a convex optimization problem. Since the optimization problem in () is convex, the stron dality will hold. Therefore, any pair of primal and dal optimal points mst satisfy the Karsh-Khn-Tcker (KKT) conditions [8]. (7) To solve the joint nonlinear eqations ()-(7), we se the Levenber Marqardt alorithm (LMA) [9]. This alorithm reqires an initial point (as an inpt) for the variables in the feasible set of constraints (5)-(). Typically, LMA is able to find the optimal soltion even with initial points that are far from the optimal one. As a reslt of solvin ()-(7), the optimal nmber of resorce blocks as well as the transmit power of each clster head are compted. IV. SIMULATION RESULTS For or simlations, we consider a set of G clsters niformly distribted in a sqare eoraphical area 5 m 5 m. The nmber of clster members randomly chanes between to. The bandwidth of each resorce block is 5 KHz. We consider a GHz carrier freqency and a maximm power of W for each CH. This power is eqally divided amon all resorce blocks. The noise power spectral density N is 7 dbm per Hz. Frthermore, de to fliht relations and environmental obstacles arond the locations of CHs, we assme that the altitdes of the UAVs randomly chane from 4 m to 6 m. We consider a path loss exponent of.5 for the CHs-UAVs commnications. Moreover, the lenth of each packet is set to bits, and the taret bit error rate is 7. All statistical reslts are averaed over a lare nmber of independent rns. In Fire 3, we show the averae transmit power of CHs verss the nmber of clsters for two scenarios. In the first scenario, we se mltiple UAVs as aerial base stations, and in the second scenario, mltiple terrestrial base stations (eqal to

As we can see from Fire 3, sin aerial base stations leads to abot 68% power redction for CHs compared to terrestrial base stations. For instance, for clsters and 6 RBs, the transmit power of CHs decreases from.6 mw to.9 mw by sin UAVs instead of terrestrial base stations. In fact, the UAVs can effectively move towards the CHs and sinificantly redce the blockae and shadowin effects. Hence, the CHs can se lower transmit power for sendin their data to the UAVs than the rond base stations. From Fire 3, we can see that the averae transmit power per CH increases as the nmber of clsters increases. This is de to the fact that, when the nmber of CHs increases, the averae time that each UAV can spend to collect data from each CH will decrease. Ths, the CH mst send its packet with a minimm time dration. Conseqently, the CH increases its transmission power to meet the taret packet rate drin the iven short time dration. Clearly, while satisfyin the rate reqirements, the transmit power of CHs can be redced by increasin the nmber of resorce blocks. Therefore, in Fire 3, the averae transmit power of CHs for 4 RBs is lower than the one for 6 RBs. In Fire 4, we show the impact of the nmber of clsters on the averae nmber of resorce blocks that mst be assined to each UAV. This is de to the fact that, as the nmber of clsters increases, the minimm nmber of needed UAVs will increase. Hence, the nmber of RBs per UAV decreases accordinly. For instance, as shown in Fire 4, as the nmber of clsters increases from to, the averae nmber of RBs per UAV decreases from 7 to 3, for a total of 4 RBs. Fire 5 shows the impact of packet transmission probability on the minimm reqired nmber of UAVs. From Fire 5, we can see that the minimm reqired nmber of UAVs sinificantly increases when the probability of packet transmission increases. This is de to the fact that, for a hiher packet transmission probability, the averae arrival rate of packets to the clster heads will increase. Therefore, the minimm reqired nmber of UAV to arantee the rate stability mst be increased. Moreover, as seen from Fire 5, the minimm reqired nmber of UAVs is also affected by the clster size. Clearly, more UAVs are needed to serve larer clsters. For instance, for a packet transmission probability of.5, 4 additional UAVs are needed when the clster size increases from to. In Fire 6, we show how the nmber of UAVs reqired for servin the CHs chanes as a fnction of the nmber of clsters. From this fire, we can see that, as the nmber of clsters increases, more UAVs mst be deployed in order to sccessflly serve the clster heads. For example, accordin to Fire 6, when the nmber of clsters rows from 5 to, the nmber of UAVs mst increase from 6 to 3 for p =.6. Frthermore, comparin the slope of the crves for p =. and p =.6, indicates that the rate of increase in the nmber of UAVs verss the nmber of clsters is hiher for a larer transmission probability. Fire 7 shows the total enery consmption of CHs as a fnction of the taret packet rate and the nmber of CHs. From Fire 7, we can see that the total enery consmption of CHs increases as the taret packet rate or the nmber of CHs increases. For hiher taret packet rate vales, the clster heads mst transmit more bits within the iven time dration. Therefore, the CHs mst increase their transmit power to send

Moreover, as the nmber of clsters increases, the UAVs mst decrease their dwellin time over each clster head in order to be able to serve all the clster heads. Conseqently, iven the shorter dwellin time, each CH will increase its transmit power to send the data to the servin UAV. V. CONCLUSIONS In this paper, we have proposed a novel framework for power-efficient clster-based MM commnications. In the stdied model, iven clsters of MM devices, UAVs are sed as aerial base stations to collect data from the clster heads (CHs). In this scenario, we have proposed an optimal schedlin and resorce allocation mechanism for CHs-UAVs commnications to minimize the transmit power of CHs while satisfyin MM devices rate reqirements. To this end, first, sin the qee rate stability concept, we have compted the minimm nmber of UAVs, and the dwellin time of each UAV to cover CHs. Next, we have determined the optimal resorce allocation for CHs-UAVs commnications sch that MM devices rate reqirements are met with a minimm transmit power.
